Nove su tehnike polučile pouzdane prognoze turističkih dolazaka s ci- ljem boljeg ekonomskog planiranja. Ovo istraživanje ima za cilj prognozirati i usporediti djelotvornost dvaju nelinearnih pristupa umjetne inteligencije u predviđanju broja turističkih dolazaka u Singapur. Mjesečni podaci o dolasku turista u Singapur korišteni su za prognoziranje mjesec, dva, četiri i šest mjeseci unaprijed pomoću nelinearnih autoregresivnih (NAR) neuronskih mreža i neuro-fuzzy (ne- izrazitih) sustava. Točnost predviđanja neuronskih mreža NAR uspoređivala se s onom neuro-fuzzy sustava pomoću različitih mjerenja učinkovitosti. Studija je pokazala da su neuro-fuzzy sustavi učinko- vitiji od mreže NAR u svim razdobljima prognoze i kod svih zemalja. Predložena neuro-fuzzy metoda poboljšava učinkovitost prognoziranja tehnika temeljenih na umjetnoj inteligenciji. Ova studija pred- stavlja doprinos literaturi u području turizma i mogu je koristiti menadžeri za učinkovito planiranje i provođenje mjera u okviru turističke politike. KLJUČNE RIJEČI: turistička potražnja; predviđanje; nelinearna autoregresivna neuronska mreža; prilagodljivi neuro-fuzzy (neizrazit) sustav zaključivanja ABSTRACT: The ever increasing demand of the tourism sector worldwide has led to an increase in tourism demand forecasting methodologies. New techniques yield much reliable predictions of tour - ist arrivals for better economic planning. The study aims to forecast and compare the performance of two non-linear artificial intelligence approaches in predicting the number of tourist arrivals to Sin- gapore. The Singapore inbound monthly tourism data were utilized to generate one, two, four and six month ahead forecasts with non-linear autoregressive (NAR) neural networks and neuro-fuzzy systems. The predictive accuracy of NAR neural networks and neuro-fuzzy systems were compared with various performance metrics. The study revealed that neuro-fuzzy systems outperformed NAR networks in all forecasting horizons and for all countries. The proposed neuro-fuzzy methodology helps in improving the forecasting performance of artificial intelligence based techniques. The study contributes to hospitality literature and could be utilized by managers to effectively plan and imple- ment tourism related policy measures. International travel and tourism havemanifesteditselftobethenotabledriversofeconomicgrowth,accountingapproximate-ly10percentofglobalgrossdomesticprod-uctandfor1in10jobsonearthinthepastdecade (WEF,2017).Developingcountriescangreatlybenefit fromthe tourismsectorin moving up the value chain. Singaporeis amajor tourist destination of theworld,ranked 13th globally in travel and tourism(WEF, 2017). Singaporewas selected as ithasbeenranked2ndinprioritizationoftrav-el and tourism and 1st in international open-nessintheworld(WEF,2017).Around16.4millionforeignvisitorsarrivedinSingaporein 2016, a 7.7% rise in comparison to thepreviousyear.Meanwhile, tourismreceiptsaccountedtoapproximately$24.8billionfor2016.Accurateforecastoftourismdemandisneededtoallocateinvestmentsbypublicand private sectors (Reynolds et al., 2013)and make business based decisions such as operation and pricing policies. Long-term and short-term forecasting are both essen-tial for planning purposes. Destination in-frastructure planning requires long termforecastingwhile short term forecastingoftourismdemandforone,twoorthreemonthahead could be utilized by destination foroperationaladaptability(GunterandOnder,2015).
Tourism demand forecasting has beenthe focus of many studies in the past de-cades. An exhaustive review of 119 pub-lished studies on tourism demand forecast-ingmethodologiesbetween2000and2007wasperformedbySongandLi(2008).Theforecastingtechniquesarebroadlyclassifiedintotimeseries,artificialintelligencebasedapproaches, econometric methods and hy-brid models. Tourism demand forecastingstudies have mostly utilized annual timeseriesdatasets.Monthlytourismtimeseriesdatasetshavefoundlessthan10%utilityin

Oko 16,4milijuna inozemnihposjetitelja zabilježeno je u Singapuru 2016.godine,štoje7,7%višeuodnosunaprethod-nu godinu. Istovremeno, prihod od turizmau2016. iznosio jeoko24,8milijardidolara.Potrebnojetočnoprognoziratiturističkupo-tražnjukakobisemoglaalociratiulaganjaujavnomiprivatnomsektoru(Reynoldset al., 2013)tekakobisemogledonijetidobrepo-slovneodlukevezaneuzposlovanjeipolitikecijena.Zaplaniranje suvažne idugoročne ikratkoročneprognoze.Planiranje infrastruk-turedestinacija zahtijevadugoročneprogno-zezaiponekolikogodinaunaprijed,dokbikratkoročneprognozeturističkepotražnjezanarednimjesec,dvaili tri,destinacijemoglekoristiti za prilagođavanje svojeg poslovanja(GunteriOnder,2015).
Prognoziranjemturističkepotražnjebavilosenizstudijauposljednjihnekolikodesetljeća.SongiLi(2008)napravilisuiscrpanpregled119objavljenih studijametodaprognoziranjaturističkepotražnjeizmeđu2000.i2007.Teh-nikeprognoziranjaugrubosupodijelilinaonetemeljenenavremenskimnizovima,naumjet-noj inteligenciji, ekonometrijskimmetodamatehibridnimmodelima.Studijeprognoziranjaturističke potražnje najviše su koristile sku-povepodataka godišnjih vremenskih nizova.Skupovi podataka o turizmu za vremenskinizodjednogmjesecakoristeseumanjeod
Modeli koji se baziraju na vremenskimnizovimapoputeksponencijalnogizglađiva-nja(AthanasopoulosideSilva,2012)iinte-griranog autoregresijskogmodela pomičnihprosjeka(ARIMA)(Assafet al.,2011;Clave-riaiDatzira,2010;Gounopouloset al.,2012)turističke dolaske prognoziraju upotrebompovijesnihpodataka.Ekonometrijskimodelipomnoistražujuodnosizmeđuturističkepo-tražnjeičimbenikakojiutječunapotražnjupoputmodelavektorskeautoregresije(SongiWitt, 2006), korekcije pogreške i modelakointegracije(Veloce,2004;Ouerfelli,2008;Lee,2011),statičkihmodelagotovo idealnepotražnje (Han et al., 2006) imodela pro-mjenjivog parametra vremena (Song et al., 2011). Predlaže se da se za prognoziranjeturističke potražnje koriste hibridnimodelipoputonihkojikombinirajuekonometrikuimetodologijerudarenjapodataka(Paiet al., 2014;Sunet al.,2016).Usto, zaprognozi-ranjeturističkepotražnjekoristeseianalizasingularnog spektra temetaanaliza (Hassa-ni, et al.,2015;Penget al.,2014).
Tehnikeumjetneinteligencije(AI)mogulakoprepoznatinelinearneuzorkeuskupo-vimapodatakapastogapredstavljajuključnumetodologijuzaprognoziranjauekonomijiiturizmu.Pristupibaziraninaumjetnojinte-ligencijimodelirajunelinearneskupovepo-dataka koristeći metodu potpornih vektora(SVM),metodupribližnihskupova,umjetneneuronskemreže(ANN)i fuzzyvremenskenizove. Hadavandi et al. (2011) predlažumodel baziran na genetskom fuzzy sustavu(GFS)zapredviđanje turističkepotražnjeuTajvanu.Paiet al.(2014)predlažuhibridnumetodologiju tako što kombiniraju fuzzyc-prosjeke (FCM) i logaritamskuvektorskuregresijupodrškenajmanjihkvadrata(LLS-SVR) za predviđanje turističke potražnje uHongKonguinaTajvanu.Pristuppribližnih
tourismdemandforecastingstudies(Songet al.,2009).Theutilizationofmonthlydatain-creasethenumberofdatapointsandprecisepredictionsareextremelycrucialfromshort-term or operation management viewpoints(GunterandOnder,2015).
Time series models like exponential smoothening(AthanasopoulosanddeSilva,2012)andautoregressive integratedmovingaverage(ARIMA)models(Assafet al.,2011;ClaveriaandDatzira,2010;Gounopouloset al.,2012) forecast the tourist arrivalsusinghistorical data. Econometric models scru-tinize the relationship between tourism de-mandand the factors affecting thedemandsuchasvectorautoregressivemodels (SongandWitt,2006),errorcorrectionandco-in-tegration models (Veloce, 2004; Ouerfelli,2008; Lee, 2011), static almost ideal de-mandsystemmodels(Hanet al.,2006)andtimevaryingparametermodels(Songet al., 2011).Hybridmodelssuchascombinationofeconometric and data mining methodologies have been proposed in forecasting tourismdemand (Paiet al.,2014;Sunet al.,2016).Moreover, singular spectrum analysis andmeta-analysis have also been employed intourismdemandforecasting(Hassani,et al., 2015;Penget al.,2014).
The Artificial intelligence (AI) tech-niquescaneasilycapturenon-linearpatternsin the dataset, making them crucial method-ologyforeconomicandtourismforecasting.AI approaches model non-linear datasets utilizing, support vectormachines (SVMs),roughsetmethod,greytheory,artificialneu-ralnetworks(ANNs)andfuzzytimeseries.Hadavandi et al. (2011) proposed a geneticfuzzy system (GFS) based model to fore-cast tourism demand to Taiwan. Pai et al. (2014) proposed a hybrid methodology bycombiningfuzzyc-means(FCM)andloga-rithmleast-squaressupportvectorregression(LLS-SVR) for predicting tourism demandto Hong Kong and Taiwan. Rough set ap-proach was utilized in predicting UK andUSAtourismdemandforHongKong(Goh

Umjetne neuronske mreže (ANN) djelo-tvornisumodeliumjetneinteligencijezamo-deliranjeiprognoziranjenelinearnogponaša-nja bez teorijskog znanja o povezanosti ula-znihiizlaznihveličina.PattieiSnyder(1996)prvisuputakoristiliumjetneneuronskemrežezaprognoziranjeturističkepotražnje.Pokaza-losedasuzapredviđanjeturističkepotražnjeumjetne neuronske mreže djelotvornije odmodela vremenskog niza (Law, 2000; Cho,2003;ClaveriaiTorra,2014).Umjetneneuron-skemrežemogusepodijelitiudvijeskupine,ovisnoonjihovojarhitekturi:acikličkemrežeimreže s povratnomvezom.Kod acikličkihmreža informacije se kreću samo u jedno-me smjeru dok kodmreža s povratnom ve-zomtekuudvasmjera.Višeslojniperceptron(MLP)najčešćejekorištenaacikličkaumjetnaneuronskamreža za prognoziranje turističkepotražnje(Claveriaet al.,2015).Drugitipaci-kličkearhitekturesuneuronskemrežesradi-jalnozasnovanomfunkcijom(RBF).Nedavnosusemrežes radijalnomfunkcijomkoristilezaprognoziranjepotražnjeza turističkimkr-starenjimauIzmiruuTurskoj(Cuhadaret al., 2014).Elmanovaneuronskamrežapredstavljaoblik mreža s povratnom vezom. Nelinear-
et al., 2008). Grey theory and fuzzy timeserieshavebeenutilized to forecastannualtourist arrivals to USA (Yu and Schwartz,2006). SVMs were first employed to pre-dict tourism demand to Barbados (Pai et al., 2006). SVMshave also been shown tooutperform ARIMA models in forecastingquarterlytouristarrivalstoChina(ChenandWang,2007).
Themostappropriateapproachfortour-ism demand forecasting cannot be deter-mined unanimously (Kim and Schwartz,2013)butthereisconsensusonthesignifi-canceofimplementationofnewapproachesto forecast tourism demand (Song and Li,2008).Ithasalsobeenshownthatnon-lin-earmodelsperformbetterthanlinearmod-elsinmodelingeconomicoperations(Cang,2014).
ANNsareefficientAImodels formod-eling and forecasting non-linear behaviorwithouttheoreticalknowledgeabouttheas-sociationbetweeninputandoutputvariables.Pattie and Snyder (1996) first employedANNs for tourism demand forecasting. IthasbeenshownthatANNsoutperformtimeseries models in predicting tourism demand (Law,2000;Cho,2003;ClaveriaandTorra,2014). ANNs can be categorized into twotypesdependingupon its architecture: feedforward networks and recurrent networks.In feed forward networks the informationmovesonlyinonedirectionwhileinrecur-rentnetworkstheinformationflowisbidirec-tional.Multi layerperceptron (MLP) is themostcommonlyutilizedfeedforwardANNsin tourism demand forecasting (Claveria et al.,2015).Anothertypeoffeedforwardar-chitectureistheradialbasisfunction(RBF)neural networks. Recently, RBF networkshavebeenemployedtoforecastthedemandof cruise tourist to Izmir,Turkey (Cuhadaret al.,(2014).Elmanneuralnetworksconsti-tuteatypeofrecurrentnetworks.Non-lineardynamicsystemshavebeenmodeledexten-sivelybyrecurrentnetworks(Haykin,1998;Ljung, 1998). Hibridne tehnike umjetne inteligencijesvesevišekoristezaprognoziranjepotražnjezbog sve veće složenosti i nejasnoće tržišta.Integriranjeneuronskihmrežaifuzzylogikepredstavlja jednu od tih hibridnih tehnika.Vrlomalostudijabaviseproučavanjemturi-stičkepotražnjekoristećipritomeneuro-fuzzy sustave.GeorgeiIoana(2007)navodedasuse neuro-fuzzysustavipokazalidjelotvorniji-maodautoregresivnogmodelapokretnihpro-sjeka(ARIMA)iautoregresivnih(AR)mode-la kodpredviđanjagodišnjegbrojadolazakaturistanaKretuuGrčkoj.Chenet al.(2010)navodedasuseprilagodljivineuro-fuzzy su-stavipokazaliboljimaod izmijenjenogMar-kovljevogrezidualnogmodela,fuzzyvremen-skihnizovaisivogprognostičkogmodelazapredviđanjemjesečnogbrojadolazakaturistaizčetirijuzemaljanaTajvan.
Ova se studija bavi primjenom i kom-parativnom analizom točnosti predviđanjadolazaka inozemnih turista u Singapur pričemusekoristedvijeparadigmeučenja,ne-linearna autoregresivna (NAR) neuronskamreža i prilagodljivi neuro-fuzzy sustavizaključivanja (ANFIS).U tu svrhukorišten

(2015) utilizedMLP, RBF and elman neu-ralnetworks topredict thenumberof tour-istarrivalstoCatalonia,Spain.NARneuralnetwork models have been used to modelnon-linearsystemssuchasmulti-hourfore-castingof small scale solar radiation (Ben-mouizaandCheknane,2016),qualitycontrolpurposes of river stage (López-Lineros et al.,2014)andenergyconsumptioninpublicbuildings (Ruiz et al., 2016). No literaturestudies could be found adopting non-linearautoregressive (NAR) neural networks intourismdemandforecasting.ThisisthefirststudythatutilizesNARnetworksintourismdemandforecasting.
Hybrid artificial intelligence techniquesarefindingeverincreasingutilizationinde-mandforecastingduetoincreasingcomplex-ityandvaguenessofthemarkets.Integrationofneuralnetworksand fuzzy logicareoneofthosehybridtechniques.Veryfewstudieshavefocusedontourismdemandforecastingusingneuro-fuzzysystems.GeorgeandIoa-na(2007)depictedthatneuro-fuzzysystemsoutperformed autoregressive–moving-aver-age(ARMA)andautoregressive(AR)mod-els in predicting annual tourist arrivals toCrete, Greece. Chen et al.(2010)showedthatadaptive neuro-fuzzy systems performedbetter than Markovresidualmodifiedmodel,fuzzytimeseriesandgreymodelinforecast-ingthemonthlynumberoftouristarrivalstoTaiwanfromfourcountries.
This study focuses on adopting andcomparative analysis of predictive accura-cyofinternationaltouristarrivalstoSinga-pore using two learning paradigms name-ly,non-linearautoregressive (NAR)neuralnetworks and adaptive neuro-fuzzy infer-ence systems (ANFIS). The official statis-tical dataset ofmonthly tourist arrivals toSingaporefromJan2006toFeb,2017wasemployed for this purpose. The intelligentmethodswereevaluated forone, two, fourandsixmonthsaheadforecastusingdiffer-

2.1 Nelinearne autoregresivne mreže

2. MATERIAL AND METHODS
TwolearningmodelswereemployedforthepurposeofforecastingtouristarrivalstoSingapore.Themethodologyinvolvedthreestages, namely data pre-processing,model-ing and comparison of prediction accuracyofboththemodels.
2.1 Non linear Autoregressive networks
Modeling time series using a linear model is difficult owing to high variationand transient characteristics of the data-sets, hence a non-linearmethodologywasutilized. Non-linear autoregressive (NAR)neuralnetworksarea typeofdynamic re-current networks. It consists of a time se-ries y at time tandutilizesthepastdvaluesoftimeseriesasinputs.Thebasicformofnon-linear autoregressive neural networkwhenappliedtotimeseriesforecastingcanbe depicted as:

Levenberg-Marquardt po-vratni postupak (LMBP), kvazi-Newtonovalgoritam, primijenjen je u ovoj studiji zafuzzynelinearneautoregresivnemreže.Leven-berg-Marquardt povratni postupak je običnonajbržipovratnialgoritam(Ruizet al.,2016).KodLMBP,derivacijadrugogredajeprocije-njenabezizračunavanjaHesseovematrice.
2.2 Neuro-fuzzy sustavi
Drugimodelkoji sekoristiouovojstu-diji jemodel poznat kao i prilagodljivi ne-uro-fuzzy sustav zaključivanja (ANFIS)kojega je predložio Jang (Jang, 1993). Onobjedinjujekarakteristike fuzzy logike i ne-uronskemreže.Fuzzy logikanemožeučitiizpodataka,aneuronskemreže lakomoguučiti izpodataka,ali jepodatkepoputoniho značaju pojedinog neurona i njegovoj te-žini teško razumjeti. Initiallyinopenstate,theNARnetworkperforms only one-step ahead predictionhence, for multi-step prediction the closedloopnetworkwasutilized (Benmouiza andCheknane, 2016). Levenberg-Marquardtbackpropagationprocedure(LMBP),aqua-si-Newton algorithm was implemented inour study for training the NAR network.LMBPisusuallythefastestbackpropagationalgorithm(Ruizet al.,2016).InLMBP,thesecondorderderivativeisestimatedwithoutthe need to calculate Hessian matrix.
2.2 Neuro-fuzzy systems
The secondmodel used in our study isthehybridintelligentmodelknownasadap-tiveneuro-fuzzyinferencesystem(ANFIS)proposedbyJ.S.R. Jang (Jang,1993). It in-herits thecharacteristicsofboth fuzzy log-ic and neural network. Fuzzy logic cannotlearnfromthedatabyitselfandneuralnet-workscaneasilylearnfromthedatabuttheinformationsuchassignificanceofeachneu-ronanditscorrespondingweightisdifficulttoapprehend.Fuzzylogicfundamentalsareusedtomapinputstooutputswiththehelpofainferencesystem,whichiscomposedof(a)a rulebase,comprising fuzzy IF-THEN

U početku je korištena otvorena nelinearna autregresivna mreža koja izvodi predviđanje samo za
jedna korak unaprijed pa je za potrebe predviđanja više koraka unaprijed korištena mreža sa
zatvorenom petljom (Benmouiza i Cheknane, 2016). Levenberg-Marquardt povratni postupak
(LMBP), kvazi-Newtonov algoritam, primijenjen je u ovoj studiji za fuzzy nelinearne
autoregresivne mreže. Levenberg-Marquardt povratni postupak je obično najbrži povratni
algoritam (Ruiz et al., 2016). Kod LMBP, derivacija drugog reda je procijenjena bez
izračunavanja Hesseove matrice.
2.2 Neuro-fuzzy sustavi
Drugi model koji se koristio u ovoj studiji je model poznat kao i prilagodljivi neuro-fuzzy sustav
zaključivanja (ANFIS) kojega je predložio Jang (Jang, 1993). On objedinjuje karakteristike fuzzy
logike i neuronske mreže. Fuzzy logika ne može učiti iz podataka, a neuronske mreže lako mogu
učiti iz podataka, ali je podatke poput onih o značaju pojedinog neurona i njegovoj težini teško
razumjeti. Temelji fuzzy logike koriste se kako bi se mapirali ulazi i izlazi pomoću sustava
zaključivanja koji se sastoji od (a) osnovnih pravila koja sadrže fuzzy AKO-ONDA pravila, (b)
baze podataka koja objašnjava funkcije članstva i (c) sustava zaključivanja za kombiniranje fuzzy
pravila i rezultata. Dva tipa najčešće korištenih fuzzy sustava zaključivanja su (1) Takagi-Sugeno
FIS i Mandami FIS. I Takagi-Sugeno i Mandami FIS razlikuju se po definiranju parametara
zaključaka pravila u mreži. U ovoj studiji koristi se Takagi-Sugeno FIS u kojemu je pravilo
AKO-TADA izvedeno na osnovi ulazno-izlaznih parova (Slika 2).

Za ustanovljavanje parametara ANFISsustava korišten je hibridni algoritam učenja(Jang,1991).Algoritamjekombinacijagradi-jentnogspuštanjaimetodenajmanjihkvadra-ta.Parametrizaključakaodređujuseprilikomprolaskapremanaprijeddokseparametripret-postavkepravilapostavljajuprilikomprolaskaprema natrag. Ulazi u mrežu prenose se dočetvrtogslojagdjesemetodomnajmanjihkva-drata određuju parametri zaključaka pravilatijekomprolaskapremanaprijed.Upovratnomkretanju algoritmom gradijentnog spuštanjanadopunjujuseparametripretpostavkipravila,apogreškaseprenosiširenjemsignalaunatrag.
Rezultati mreža NAR i ANFIS-a vred-novani su pomoću standardne devijacije(RMSE)isrednjeapsolutnepogreške(MAE).MAEjemogućedefiniratikaoprosjekapso-lutnih pogrešaka. MAE pokazuje koliko supredviđenevrijednostiblizuciljanihvrijedno-sti.RMSEpredstavljadrugikorijenprosječnevrijednostikvadrataodstupanja.
Za komparativnu analizu prognoziranjaturističke potražnje korištena je dvodjelnaarhitektura.Zadizajniranje iučenjeneline-arne autoregresivne neuronskemrežeNARkorištenjeMATLAB2012aNeuralNetworkToolbox, a za dizajniranje i optimizacijuarhitektureANFIS-a rabio seMATLAB’s2012aFuzzy Logic Toolbox.

Hybridlearningalgorithmwasemployedfor the identification of parameters in theANFISsystem(Jang,1991).Thealgorithmisacombinationofgradientdescentandleastsquaresmethod.Theconsequentparametersare tuned in the forward passwhile prem-iseparametersareadjustedinthebackwardpass. Network inputs are propagated up tolayer 4 where consequent parameters aredetermined by least-squares method in theforwardpass.Inthebackwardpass,gradientdescent updates the premise parameters and theerrorispropagatedbackwards.
The metrics used for valuating perfor-manceoftheNARnetworkandANFISarerootmean square error (RMSE) andmeanabsoluteerror(MAE).MAEcanbedefinedas theaverageofabsoluteerrors.MAEde-noteshowclose thepredictedvaluesare tothe target values. Meanwhile, RMSE in-volvessquarerootoftheaveragevalueofthesquareoftheerror.
A bipartite architecture was employedfor thecomparativeanalysisof tourismde-mandforecasting.FordesigningandtrainingtheNARneuralnetwork,MATLAB’s2012aNeuralNetworkToolbox and for designingand optimization of ANFIS architecture,MATLAB’s2012aFuzzyLogicToolboxwasemployed.
Mjesečni turistički podaci dobiveni suiz Statističkog odjela u Singapuru (www.singstat.gov.sg). Skup podataka obuhvaćaojebrojdolazakaturistauSingapurodsiječ-nja 2006. do veljače 2017. Za razdoblje od12/2014 do 2/2017 izračunate su procjenedeskriptivnih statistika turističkih dolazakauSingapur.OdsvihzemaljaKinapokazujenajvećuvarijaciju,aMalezijanajvećuasime-tričnost izaobljenostdistribucije turističkihdolazaka(Tablica1).
2.3 Dataset

3. REZULTATI
Za testiranje kompetencije umjetne ne-uronskemreže (ANN) korištena jemetodapodijeljene validacije. Podaci su podijeljeniu tri skupa, u svrhu fuzzya, validacije i te-stiranja.Koristioseskupza fuzzyekojiod-govara težinamamodelaNAR, skupzava-lidaciju korišten je dabi se odabraomodelkoji imanajboljusposobnostgeneralizacije,a skup za testiranje rabio se za testiranjeodabranogmodelananeviđenimpodacima.Polazniskuppodatakazafuzzyesastojaoseod68mjesečnihopažanja(50%)odsiječnja2006.dokolovoza2011.,39mjeseciodrujna2011.dostudenog2014.(30%)kaoskupzavalidaciju,aposljednjih20%kaotestniskup.
Primijenjena je iterativna skica progno-ziranja tako da je nakon svake prognozeveličinaskupapovećanazajednorazdoblje,avalidacijaskupaproširenazadodatnoraz-doblje. Iterativni postupak ponavljan je svedokskupzatestiranjenijeuključivaoiraz-doblje s procijenjenim podacima. Rezultatiskupazavalidacijukorištenisuzaodabirop-timalne topologije iparametaramreže.Ne-linearna autoregresivna neuronska mreža sjednimulaznimijednimizlaznimneuronomtreniranajetijekom1000epoha.Kakobisena najveću moguću mjeru smanjila greškaizmeđu stvarnih i predviđenih vrijednosti,mrežajetreniranatakodasevariraobrojne-uronauskrivenomsloju.Mrežesusimultanotreniranesrazličitimaktivacijskimfunkcija-ma poput tangentno sigmoidalne, log sigmo-idalne i linearne. 3. RESULTS
The split validationmethodwas imple-mentedtotestthecompetenceofANN.Thedatawassplitintothreesetsfortraining,val-idation and testing purposes. The training set isutilizedtofitweightsoftheNARmodel,thevalidationsetisusedtoselectthemodelwhichprovides best generalization capabil-ity and the test set is employed for testingthe selected model against unseen data. The initial training dataset consisted of first 68monthly observations (50%) from January2006 to August 2011, the next 39 monthsfrom September 2011 to November 2014(30%)asvalidationsetandthe last20%astest set.
Aniterativeforecastingschemewasim-plementedwhereinafterevery forecast, thesizeof thesetwas increasedbyoneperiodandthevalidationsetwasslidedbyanotherperiod.Thisiterativeprocedurewasreiterat-edtill thetestsetcomprisedofout-of-sam-pleperiod.Validationset’sperformancewasutilized for selecting the optimal topologyand parameters of the network. The NARnetworkwithoneinputandoneoutputneu-ronwas trained for 1000 epochs. Tomini-mizetheerrorbetweenactualandpredictedvalues, thenetworkwas trainedbyvaryingthe number of neurons in the hidden layer.The networks were simultaneously trainedwith different transfer functions such astangential sigmoid, log sigmoid and linear. Theneuro-fuzzymodelwasrunwithdiffer-ent typesandnumberofmembershipfunc-tions.Thenumbersofmembershipfunctionswerevariedbetween2to6andinputmem-bership functions were triangular (trimf),

Neuro-fuzzy sustavinakonučenjatakođerzahtijevajupo-stupakvalidacijekakobisevalidiralipodaciipotvrdilanjihovasposobnostgeneralizacije(Efendigilet al., 2009).Kao i kodChenet al. (2010), kao skup za validaciju korištenisuneviđenipodacikakobisepotvrdilaspo-sobnost generalizacije modela neuro-fuzzy sustava(rujan2011.–veljača2017.).
Pretpostavlja sedamodelANFIS smi-nimalnom standardnom devijacijom na-kon jedne epohe fuzzya može konvergiratiu niži model standardne devijacije nakonvišeepohafuzzya (Mohammed et al.,1995).OptimalnaučinkovitostmodelaAImožesepostići kombinacijom parametara. Stoga jeprimijenjenaeksperimentalnametodapoku-šajaipogreškeili‘promijenijedanpojedanfaktor’(Efendigil et al.,2009).Korištenajetehnika višestrukih pokretanja pri čemu jefazafuzzyaponavljanatriputakakobisepo-stigleniskevrijednostiodstupanjaiizbjegaoproblemlokalnihminimuma(Claveriaet al., 2015).Rezultatipredstavljeniustudijiodgo-varajunajboljojtopologijiinajnižimvrijed-nostimaodstupanja.
Provedeno je iscrpno istraživanje kakobi se ustanovila optimalna topologija mre-žakojadajenajmanjegrešaka.Korištenajemetoda mrežne podjele za generiranje op-timiziranih fuzzy pravila zaANFIS sustav.Odabrana je poopćena zvonolika funkcijakaoeksperimentalnafunkcijačlanstvapoštoonadajenajniževrijednostiRMSE.Pokaza-losedanelinearniparametrimogunajboljepoopćiti pomoću zvonolikih funkcija član-stva(Mladenovicet al.,2016).Usto,unašojstudijizafunkcijučlanstvaizlazaodabranjelinearnitip.NajboljirezultatizaNARmrežepostignuti su s topologijom s jednim skri-venimslojemi10do30skrivenihneurona.

It is assumed that the ANFIS model with theminimumRMSE after one epochof training can converge to a lowerRMSEmodel after more epochs of training (Mo-hammed et al.,1995).Optimalperformanceof AI models can be achieved through acombinationofparameters.Hence,trialanderroror‘changeonefactoratatime’exper-imentation methodology was implemented(Efendigil et al., 2009).Amulti-start tech-niquewas employed, inwhich the trainingphasewasrepeatedthreetimestoobtainlowerrorvaluesandavoid theproblemof localminima (Claveria et al., 2015). The resultspresentedinthestudycorrespondtothebesttopologyandlowesterrorvalues.
Anexhaustive searchwasperformed toidentifytheoptimaltopologyofthenetworkswhich givesminimumerror.Grid partitionmethodology was employed for generatingthe optimized fuzzy rules for the ANFISsystem.Ageneralizedbell shaped functionwaschosenastheexperimentalmembershipfunction as it gave lowestRMSEvalues. Ithas been shown that non-liner parameterscanbebestgeneralizedbybell-shapedmem-bershipfunctions(Mladenovicet al.,2016).Meanwhiletheoutputmembershipfunctionwassettolineartypeinourstudy.Thebestresults for NAR networks were obtainedwith the topology of one hidden layer and10 to 30 hidden neurons. Kad se pomoću NAR mreže provelopredviđanje jedan mjesec unaprijed, usta-novljenjenajnižiRMSEod0,2027zaostalezemlje.Neuro-fuzzymodelzabilježiojenaj-nižiRMSE od 0,1284 za SAD (Tablica 3).Najniži MAE od 0,1584 ustanovljen je zaostalezemljekodmodelaNAR,dokjemodelANFISpokazaonajnižiMAEod0,0990zaostalezemlje (Tablica4).KodsvihzemaljapripredviđanjimazajedanmjesecunaprijedmodelANFISpokazao seučinkovitijimodmodelaNARikodtehnikamjerenjaRMSEi MAE.
Najniži RMSE od 0,1009 uočen je zaSADkodpredviđanjaANFIS-omdvamje-secaunaprijed.IstovremenomodelNARpo-stigaojeRMSEod0,1518zaUSA(Tablica3).VrijednostMAEod0,1245zaUSAbilajenajnižaodsvihzemaljakodNAR-a,dokjemodelANFISdaonajnižiMAEod0,0602za ostale zemlje (Tablica 4). I ovdje se ne-uro-fuzzymodelpokazaoboljimodmodelaNARzapredviđanjadvamjesecaunaprijed.TrebaimatinaumudajeMAElinearanre-zultat kod kojega svaka greška doprinosi sistom težinom prosjeku, dok RMSE slijedipravilo kvadratne pogreške. Kod RMSE,greškeseračunajukvadriranjemnakončegaseizračunavaprosjekpastogavelikegreškeimaju veću težinu. Ta karakteristika možebitioportunakadsuvelikegreškeneprihvat-ljiveustatističkommodelu.Tehnikamjere-nja grešaka treba biti dovoljno pogodna zarazlikovanjerezultataprognoziranjadvamo-dela.RMSEjetipičnoboljikodsugeriranjarazlika izmeđuučinkovitostimodela (Arm-strongiCollopy,1992).
Točnostpredviđanjaobamodelapoveća-vasenakondodavanjadodatnihinformacijaodolascimaturistauprethodnimmjesecima.NajnižavrijednostRMSEod0,0289uočenaje kod ostalih zemalja (šest mjeseci una-prijed) dok su najnižeMAE vrijednosti od

When onemonth ahead prediction wasperformed with NAR network, the lowestRMSEof0.2027wasobservedforrestofthecountries.Meanwhiletheneuro-fuzzymodelrecordedthelowestRMSEof0.1284forUSA(Table 3). The lowestMAE of 0.1584 wasobserved for rest of the countries forNARmodel, while the ANFIS model recordedthelowestMAEof0.0990fortherestofthecountries(Table4).Amongallthecountriesforonemonthaheadprediction,theANFISmodeloutperformedtheNARmodelinbothRMSE and MAE metrics.
The lowest RMSE of 0.1009 was ob-servedforUSAintwomonthaheadpredic-tionofANFIS.Meanwhile,theNARmodelobtainedtheRMSEof0.1518forUSA(Table3).TheMAEvalueof0.1245forUSAwasrecorded the lowest among all countries inNARwhiletheANFISmodelgavethelowestMAEof0.0602fortherestofthecountries(Table4).Herealso,neuro-fuzzymodelout-performed theNARmodel for twomonthsahead prediction. It should be kept in mind thatMAEisalinearscorewhereeveryerrorhasequalweightintheaveragewhileRMSEhas quadratic error rule. In RMSE, errorsaresquaredandthenaverageistaken,hencelargeerrorspossesshigherweight.Thistraitcanbeconvenientwhenlargeerrorsareun-acceptable in a statistical model. The error metrics should be sufficiently competent todifferentiatebetweentheresultsofthefore-castoftwomodels.RMSEistypicallybetterinsuggestingthedifferencebetweenmodelsperformance(ArmstrongandCollopy,1992)
The prediction accuracy of bothmodelsincreases upon incorporating additional in-formationof previousmonths of tourist ar-rivals. The lowest RMSE value of 0.0289wasseeninrestofthecountries(sixmonthahead),whilethelowestMAEvalueof0.0101wasdepictedforIndia(sixmonthahead)inall forecasting horizons. A considerable

Nadalje, kako bi se usporedila točnostpredviđanjadvijuprognoza,provedenjetestDM(DieboldiMariano,1995)kojiocjenju-
differencewas observed in the RMSE andMAEvaluesofNARandANFISnetworksduringfourandsixmonthaheadpredictions.TheRMSE andMAE values ofANN andANFIS displayed a decreasing trend uponincreasing the number of time steps. ThissignifiesthatbothANNandANFISmodelswithlessknowledgearenotcapableenoughtomodelthedataandgivehigherRMSEandMAEvalues.
Furthermore, to compare the predictiveaccuracyofthetwoforecasts,Diebold-Mari-ano(DM)testwasperformed(Dieboldand
jekojimodelimaboljutočnostpredviđanjailikodkojegajesmanjenjegreškestatističkiznačajno. Taj test za uspoređivanje točno-sti testira nultu hipotezu prema kojoj dvijeprognozeimajuistuprediktivnutočnost.Zaprocjenjivanje matrice kovarijanci gubitkatočnostikorištenjeprocjeniteljNewey-Westtipa.Pozitivanznakukazujenatodajepo-greškauprognoziranjuizprveserijevišauusporedbisaserijomskojomseuspoređujedoknegativanznakoznačavasuprotno.Pri-likom evaluacije značajne razlike izmeđudvijuuključenihserija(Tablica5),ustanov-ljeno jeda jeANFISmodelučinkovitijiodmodelaNARzasvarazdobljaprognozeizasvezemlje.
Planiranjeikontroliranjepriljevaturistaodključnejevažnostiuturizmu.Točnepro-gnozeturističkepotražnjeključnesuzaovugospodarskuaktivnost jeronausebiobje-dinjujeneuskladištiveproizvodepoputho-telskihsobaisjedalauavionima.Precizneinformacijeo turističkojpotražnji iprilivuturistaizrazličitihregijamogupomoćipla-nerimapolitikauodržavanjuipovećavanjusnage turizma određene zemlje. Opisananeuro-fuzzy metoda pruža bolje i točnijeprognozeturističkihdolazakanegoneuron-skemreže.Ovatehnikatakođerprevladavanedostatke kako neuronskihmreža, tako ifuzzy logike. Neuro-fuzzydizajnmoguko-ristiti menadžeri prilikom kreiranja mar-ketinškog plana u turizmu.Točne progno-ze mogle bi vladama i privatnom sektoruomogućitikreiranjedjelotvornestrategije ipružanje bolje usluge posjetiteljima, poputinfrastrukture.
4. ZAKLJUČAK
Uovojstudijipredložilismonovuarhitek-turuprognoziranjazapredviđanjebrojadola-zakaturistauSingapur.Predviđanjeturističkepotražnje zahtijeva nelinearnu metodu zbogvolatilnostiskupovapodataka.Skuppodatakasadrži obrasce koji mogu smanjiti djelotvor-nostneuronskemrežeprilikomizvođenjaza-

Planning and control of tourist inflowis essential for the tourism industry. Theaccurate forecasting of tourism demand isessential for this sector as it incorporatesperishable products such as hotel rooms and airlineseats.Preciseinformationontourismdemandandtouristinflowsfromvariousre-gionsmayhelpthepolicyplannerstomain-tain and augment the tourism sector of thecountry. The above proposed neuro-fuzzymethodology provides better and accurateforecastsof touristarrivals thanneuralnet-works. This technique also overcomes theshortcomings of both neural networks andfuzzy logic. The neuro-fuzzy design couldbe utilized by managers in formulating amarketing plan for tourism sector of thecountry. Accurate forecasts could enablegovernmentsandprivatesectortoformulateanefficientstrategyandprovidebetterfacili-tiessuchasinfrastructuretothevisitors.
4. CONCLUSION
Inthisstudyweproposeanewforecast-ing architecture for predicting the numberof tourist arrivals to Singapore. Tourismdemand forecasting requires a non-linearmethodologyduetovolatilityofthedatasets.The dataset contains patterns that can hinder the effectiveness of neural network to de-

ključakao složenimfenomenima izvremen-skogniza.Fuzzy logikaineuronskemrežesui međusobno komplementarne te se koristiokombinirani pristup kako bi se poboljšalauspješnostprognoziranjapotražnje.Korištenasu dva nelinearna inteligentna modela, neu-ro-fuzzy sustavi i nelinearne autoregresivneneuronskemrežekakobiseproizveleprogno-ze turističkepotražnje za jedan, dva, četiri išestmjeseciunaprijed.Timodelipredstavlja-ju nekonvencionalan način obrade podatakao turističkojpotražnji.Glavniciljovestudijebio je poboljšati učinkovitost prognoziranjaturističkepotražnjeupotrebomhibridnihinte-ligentnih modela. ducecomplexphenomenonfromtimeseries.Fuzzy logic and neural networks are bothcomplementary to each other, and hence acombinatorial approach is used to improvethe demand forecasting performance. Twonon-linear intelligent models, neuro-fuzzysystems and non-linear autoregressive neu-ral networkswere utilized to generate one,two, three and sixmonthahead forecastoftourism demand. The models represent un-conventional ways of treating the touristdemand information. The main objectiveofthisstudywastoimprovetheforecastingperformance of tourism demand by usinghybrid intelligent models. The neuro-fuzzymodeloutperformed theNARmodel in allforecastinghorizons. Itwasalso found thaton increasing the historical tourism infor-mation,thepredictiveaccuracyofboththemodels improved significantly. Precise de-mandforecastsarecrucialfortourismman-agement and groundwork in business andpublic sectors.The studyhas some limita-tions as furtherwork is required to gener-alize the findings. Exhaustive testing withdifferent tourism destination datasets canprovide additional insights to tourism pro-fessionals.
